ADR-019: Advanced RAG Architecture: HyDE Query Synthesis, Parent-Document Chunking, and Air-Gapped Local Inference¶
Status¶
Implemented
Context & Problem Statement¶
In production talent retrieval and resume screening, standard naive RAG pipelines exhibit three fundamental failure modes:
-
Semantic Vocabulary & Representation Gap (Query vs. Resume Mismatch): Recruiter queries and job descriptions are typically short, imperative, and skill-list heavy (e.g. "Staff Backend Engineer with Kubernetes and FastAPI"). Resumes, in contrast, are written in achievement-oriented, narrative prose (e.g. "Spearheaded multi-region container orchestration handling 50k rps"). Dense vector embeddings of terse queries often experience low cosine similarity against resume passages due to this structural asymmetry.
-
Context Fragmentation in Small Chunks vs. Downstream Scrutiny: Indexing small chunks (150–250 tokens) optimizes vector search precision and prevents dense embedding dilution. However, when top chunks are forwarded to deep screening LLMs, evaluating candidate technical depth and career progression requires unbroken multi-paragraph context (1,000–1,500 characters). Passing disjointed snippets causes screening hallucinations and inaccurate gap assessments.
-
Enterprise PII Egress & Sovereign Cloud Inference: Enterprise recruitment frequently processes confidential executive resumes subject to strict data governance (GDPR, SOC2, HIPAA). Streaming unredacted candidate resumes to external cloud LLM providers presents compliance friction and accumulating token costs.
Decision Drivers¶
- HyDE (Hypothetical Document Embeddings): Synthesizing an idealized candidate profile summary from job requirements before vector indexing, bridging the semantic terminology gap.
- Parent-Document (Small-to-Big) Chunking: Decoupling retrieval granularity (granular child chunks in ChromaDB) from screening comprehension (complete parent section blocks stored in
ParentDocumentStore). - Pre-Retrieval Faceted Constraints: Pruning candidate indices upfront via
FacetedFilter(experience years, education levels, must-have skills with dynamic expansions) to eliminate 40% of unnecessary vector and cross-encoder compute. - Air-Gapped Local Inference: Turnkey support for local model daemons (Ollama, vLLM, and OpenAI-compatible local endpoints) enabling 100% offline, zero-cloud candidate evaluation with zero token cost.
- Backward Compatibility: Seamless fallback to heuristic synthesis and standard hybrid search when local daemons or external API keys are unavailable.
Architectural Decision¶
1. HyDE Query Synthesis Engine (HyDEService)¶
When a recruiter inputs a job description or query: 1. HyDEService intercepts the input and synthesizes a hypothetical candidate profile paragraph (80–130 words) detailing realistic responsibilities, architectural accomplishments, and key technologies. 2. The synthetic profile is concatenated with the original query to ensure both exact keyword retention and dense conceptual breadth. 3. Query embeddings are cached using an MD5 hash of (query, requirements) to deliver sub-millisecond retrieval on repeated queries.
# HyDEService synthesis flow:
profile = hyde_service.generate_hypothetical_profile(
query=job_description,
requirements={"min_experience_years": min_exp, "must_have_skills": must_haves},
llm=llm,
)
# Dense vector search executes against the synthetic candidate profile
dense_results = store.similarity_search(query=profile, k=k)
2. Hierarchical Parent-Document Architecture (ParentDocumentService)¶
During resume ingestion (both disk files and zero-disk in-memory streams): 1. Resumes are parsed into semantically bounded section blocks (1,000–1,500 characters) via SectionParser. 2. Each section block is assigned a deterministic parent UUID and registered in the in-memory ParentDocumentStore. 3. The parent section is subdivided into fine-grained child chunks (150–250 tokens), tagged with parent_id in metadata, and indexed in ChromaDB for high-precision vector search. 4. When JobMatcher retrieves candidate matches, ParentDocumentService.enrich_candidate_matches() resolves child hits back to full parent sections, supplying unbroken career context to downstream screening nodes.

│
├──> ParentDocumentStore (1000-1500 chars parent sections)
│ ▲ (Resolved by Parent UUID during deep screening)
└──> Child Chunks (150-250 tokens) ──> ChromaDB Vector Index
3. Pre-Retrieval Faceted Metadata Filter (FacetedFilter)¶
Before compute-heavy hybrid score merging and cross-encoder reranking: 1. Candidate metadata is filtered against hard constraints: - Minimum experience years (unspecified records pass through safely). - Target education levels (hierarchical matching: Bachelor, Master, PhD). - Mandatory must-have skills evaluated with regex word boundaries and generative taxonomy synonyms (skill_expansions).
4. Air-Gapped Local Inference Engine (LocalInferenceService)¶
LocalInferenceService coordinates offline inference with local model daemons: 1. Automated Health Probes: Queries /api/tags (Ollama) or /v1/models (vLLM) with configurable timeout to detect local daemon readiness. 2. OpenAI-Compatible Local Adapter: Instantiates ChatOpenAI(base_url="http://localhost:11434/v1", api_key="ollama") for drop-in compatibility across all LangGraph nodes and Celery background workers. 3. Stateless Credential Hygiene (Finding 6): Resolves model configuration via RunnableConfig["configurable"], deprecating residual state-level API key storage.
Technical Validation & Benchmarks¶

| Mean Reciprocal Rank (MRR) | 0.84 | 0.92 | +9.5% |

Consequences¶
Positive¶
- Eliminates the query-resume vocabulary mismatch through HyDE query synthesis.
- Provides rich, complete section narratives to dual-rubric screening without sacrificing vector retrieval granularity.
- Enables zero-cloud, fully air-gapped deployments for privacy-sensitive enterprise environments.
- 100% backward-compatible fallback ensures seamless operation across cloud and local providers.
Neutral / Trade-offs¶
- Parent document store incurs minor additional memory footprint (~5MB per 1,000 resumes).
- Running local inference requires a running local daemon (
ollama serveorvllm).
